How does data augmentation work?

Data augmentation is a technique used to increase the diversity and size of a dataset by applying random transformations and modifications to existing data points. The goal is to generate new training examples from the original data to improve the performance and robustness of machine learning models.

Some common data augmentation techniques include:

  • Random cropping: Randomly cropping images to create new examples at different scales and aspects ratios. This helps a model generalize to different object shapes and sizes.

  • Flipping and rotation: Horizontally or vertically flipping images provides new viewpoints. Rotating images also exposes the model to different orientations. This improves invariance to rotation and flips.

  • Color shifting: Adding noise, adjusting brightness, contrast, hue, and saturation introduces variation in color that the model must learn to handle. This makes the model more robust to color changes.

  • Blurring or sharpening: Introducing blur or increasing sharpness forces the model to rely less on fine texture details and more on overall shape and structure. This improves generalization.

  • Geometric warping: Applying affine transformations, elastic deformations, or perspective warps simulates viewpoint changes and shape distortions. This helps with pose variation and robustness.

Data augmentation generates varied synthetic training data from existing examples without the need to collect new data. By training machine learning models on augmented datasets, the models learn invariance to common input variations and generalize better to unseen data. This improves model accuracy and reduces overfitting. The key is to apply augmentations that generate plausible and useful variations rather than unrealistic corruptions of the data.

Why is data augmentation important?

Data augmentation techniques are a vital tool for constructing accurate and robust machine learning models, particularly when working with limited quantities of training data.

With small datasets, machine learning models are prone to overfitting, where they memorize the noise and details of the small training set which don't generalize well to new data. Augmentation provides a means to artificially expand the dataset by applying transformations such as cropping, flipping, rotating, color shifting, and geometric warping, as explained in the previous section. 

These techniques expose the model to far more training examples than the original dataset contains. The artificial examples exhibit variations that are realistic and representative of how the model will be used in practice. 

By training on this expanded and varied dataset, the model is forced to learn more robust features rather than latching onto spurious patterns. The model can extract fundamental elements that generalize better to diverse real-world data. 

Without augmentation, a model trained on a small dataset may achieve high training accuracy but fail dramatically when deployed. The expanded and regularized training imposed by augmentation techniques greatly improves model accuracy and resilience when integrated into an ML pipeline with limited data. This makes augmentation an essential capability for successfully developing machine learning models in data-constrained situations.

Why does data augmentation matter for companies?
